AI has a well-documented but poorly understood transparency problem. A significant portion of business executives—51%—report that AI transparency and ethics are critical for their operations. Notably, 41% of senior executives indicate that they have suspended the deployment of an AI tool due to potential ethical concerns.

To fully grasp why AI transparency presents such challenges, it is essential to reconcile common misconceptions with the realities of AI transparency. This understanding will pave the way for addressing transparency within the context of current machine learning (ML) tools in the market.

Technical Complexities Perpetuate Black Box AI

The development of DevOps tools was fueled by the need to detect and eliminate bugs in software applications, which could cause unexpected disruptions or risks. The DevOps framework allows for faster and enhanced software delivery, improved automation, swift problem-solving, and greater visibility into system performance.

In a similar vein, MLOps has emerged to address the operational needs of developing and maintaining ML systems, although the practice is still in its infancy. Unlike traditional software development, many machine learning systems currently deployed suffer from a lack of transparency regarding their inner workings. This dilemma arises from the inherent technical complexities of AI systems.

While it is feasible to construct interpretable machine learning models—simple decision trees being a prime example—such models are not always effective for achieving complex objectives.

For high accuracy in machine learning models, the system must be fed a substantial volume of quality data that accurately represents real-world situations. As thousands or even millions of data points and hundreds of heterogeneous features are analyzed, the complexity increases, rendering the system’s operations less comprehensible, even to the developers.

The opacity of machine learning extends to both supervised and unsupervised models. In supervised models, such as support vector machines, opacity can stem from high dimensionality, numerous transformations applied to data, non-linearity, and the use of complementary techniques like principal component analysis.

Similar to support vector machines, algorithms such as random forests—widely used in finance for fraud detection—suffer from interpretability issues due to the numerous decision trees involved and the feature bagging process. Unsupervised models, like k-means clustering, also lack transparency, making it challenging to determine which features contributed most significantly to the final output.

Organizations may fear that revealing the source code, underlying mathematical model, training data, or even the inputs and outputs of a machine learning model could jeopardize customer trust. Misconception #3: Lack of Protected Data Equals No Bias

Organizations often lack access to protected class data, complicating their ability to validate models for bias. However, bias can infiltrate a model at any project phase, stemming from under-representation in training datasets.

Reality #3: Access to Protected Data Helps Identify Biases

Providing access to protected class data can help mitigate biases by allowing practitioners to see which segments are affected and take corrective measures.

Misconception #4: Transparency Risks Intellectual Property

The tension between the desire for AI transparency and the need to protect intellectual property is palpable. Companies like Google and Amazon maintain secrecy over their algorithms to prevent misuse.

Reality #4: Transparency Does Not Mean Losing IP

Transparency can be achieved without disclosing sensitive intellectual property. End-users need not know the intricate workings of an ML system; they simply require an understanding of what variables led to a specific output.

Overcoming Black Box AI with ML Observability Tools

To ensure transparency to external parties, organizations must utilize purpose-built tools that offer insights into their ML systems. ML observability refers to the practice of obtaining a comprehensive understanding of a model’s performance throughout its lifecycle.

ML observability platforms monitor statistical changes in data and provide insights into the root causes of model performance issues. This capability allows organizations to transform black box models into “glass box” models, enhancing transparency and accountability.

As AI systems increasingly infiltrate critical sectors such as criminal justice and banking, ensuring transparency is paramount for maintaining trust among stakeholders, including consumers and regulators.
